Designing machine learning applications can be challenging, especially software architectures for handling real-time sensor data processed by compute- and software-intensive machine learning applications. This paper answers the two research questions: "Which parts of a machine learning pipeline do novel software architectures and framework optimize?" and the associated question of "Which parts do the architect then need to focus on?". The presented experiences and experimental results suggest that novel software architectures and frameworks optimize the learning and classification part of the pipelines. Therefore, the architect in particular needs to focus on data distribution and preprocessing as these parts were observed to have an overlooked computational cost and complexity. These results are important for software architects to become better at architecting machine learning-based systems.

In the ever -evolving landscape of edge computing environments, the demand for robust historical data storage and caching solutions has emerged as a critical requirement across diverse scenarios, spanning from mitigating the impact of network outages to facilitating AI/AIL applications and accommodating the dynamic movement of edge devices. This technical paper presents a comprehensive case study focusing on the design and implementation of a lightweight, yet efficient data storage and caching solution tailored specifically for the MQTT Broker within the realm of edge computing. Within the Siemens Industrial Edge platform, the Eclipse Mosquitto broker, known as Databus, lacks inherent support for historical data storage and caching mechanisms. To bridge this gap, a meticulous evaluation of various databases was conducted, culminating in the selection of SQLite for data storage and Redis for in-memory caching. The study meticulously delineates the architectural decisions guiding the optimization of this solution, including strategies such as timeseries storage, periodic disk writes, temporary buffering, and the provision of configurable storage and caching options. By facilitating swift and resource -efficient data retrieval, the developed solution is tailored to cater to the stringent requirements of low -power edge devices operating within embedded system environments, ensuring optimal performance and scalability.

The phenomenon of software architecture degradation over time highlights how systems tend to become increasingly error-prone and resistant to change as they evolve. Changes in architecture may arise from existing bugs and their subsequent fixes. Therefore, it is important to understand which bugs might lead to changes in the existing architecture upon resolution. In this paper, we present a framework aimed at comprehending this degeneration by delving into the origins of bugs. With a better understanding of these origins, we can pinpoint the emergence of bugs resulting from pre-existing flaws or changes within the software architecture, which can lead to architecture decay. This understanding enables us to devise targeted bug management strategies, including bug prediction, localization, and detection. Through our framework, our objective extends beyond merely enhancing bug-fixing processes towards shaping the trajectory of software architecture evolution. By proactively addressing bugs at their root causes, particularly those intertwined with the software architecture, we can aim to slow the degradation of software systems and foster the development of more resilient and adaptable architectures.

The development of automotive systems has become more complex due to the growing demand for sophisticated features, the necessity for smooth integration of technology, and faster production schedules, leading to numerous challenges in their development. To tackle some of these challenges, this paper introduces a practical method designed to simplify the early design and assessment stages of complex automotive systems through the use of sophisticated systems engineering methodologies. It details the combination of systems Modeling Language (SysML) and IBM Rational Rhapsody's Parametric Constraint Evaluator (PCE) within an improved Model-Based systems Engineering (MBSE) framework aimed at the development of complex systems. This fusion enables the virtual evaluation of parametric constraints and the analysis of engineering performance for different system configurations, thus enhancing the process of engineering analysis. We demonstrate the practicality and effectiveness of this approach using a generic automotive powertrain case study. This involves modeling a system based on specific requirements and evaluating its performance across predetermined configurations. Furthermore, the versatility of the MBSE framework is highlighted, showing its applicability beyond the automotive industry to encompass a wide range of engineering domains. This study aims to pave the way for more efficient and manageable development processes in the face of growing system complexity.

Runtime orchestration of cloud-native microservice systems remains a challenge with many technology options, such as Kubernetes for managing containers and OASIS TOSCA, a standard for orchestrating cloud services. Researchers and practitioners have proposed different approaches on how the benefits of Kubernetes and TOSCA could be combined, but followed different design philosophies and did not reach consensus. An analysis of the different combinations is missing and existing TOSCA and Kubernetes combinations do not consider the integration of real-time embedded controllers without container workloads, nor a safeguarding of configuration changes, which can be achieved using the GitOps paradigm. In this experience report, we describe and analyze different options for combining TOSCA and Kubernetes. Following one of the options, we have enhanced an existing TOSCA orchestrator to demonstrate software updates across heterogeneous software services as well as a GitOps extension for TOSCA service models. We found that TOSCA workflows are well suited for updates spanning different technologies and that a custom GitOps operator is needed in case not all components are orchestrated by Kubernetes.

With the emergence of decentralized and opportunistic approaches to machine learning, end devices increasingly train models on-device using crowd-sourced data they collect themselves. These approaches are desirable from a resource perspective and also from a privacy perspective. When the devices benefit directly from the trained models, the incentives are implicit - contributing devices are incentivized by the availability of the higher-accuracy model that results from collaboration. However, explicit incentives must be provided when end-user devices are asked to contribute their resources (e.g., computation, communication, and data) to a task performed primarily for the benefit of others, e.g., training a model for a task that the device owner is uninterested in. We propose a novel blockchain-based incentive mechanism for completely decentralized and opportunistic learning architectures. We leverage a smart contract not only for providing explicit incentives to end devices to participate in decentralized learning but also to create a fully decentralized mechanism to inspect and reflect on the behavior of the learning architecture.

Many enterprises are opting for the multi-cloud deployment of their complex workflows to avoid vendor lock-in, ensure high reliability, and achieve cost-effective high performance. However, optimally mapping workflows to the cloud services and instances in a multi-cloud environment has many inherent challenges. Cloud service providers (CSPs) have unique cost models. Moreover, various features offered by the corresponding services from multiple cloud service providers differ significantly. Hence, optimal deployment requires a judicious selection of cloud services and their configurations offered by multiple CSPs. Serverless deployment of workloads in the cloud is emerging as a preferred choice due to its high scalability, and cost-effective pay-per-use cost model. In this work, we present analytical model and simulation-based approaches for estimating the makespan and cost of mapping complex workflows to serverless architecture in a multi-cloud environment. Additionally, the schedules generated using a well-known simulator with a brute-force algorithm and an analytical model are evaluated on real cloud instances. We observe an improvement of 53% in the makespan of the workflow and 30% in the cost of deployment when compared with the worst and intuition-based deployment scheme.

In recent years, the architecture and structure of Deep Neural Networks (DNNs) have become progressively more complex in order to respond to the increasing complexity of real problems. A strategy to deal with this complexity when it affects training would be to partition DNN training in some way: for example, by distributing it among different components of a computer network. For this, training (which is in essence the minimization of the loss function) should be performed through separated "smaller pieces". This paper offers an alternative to the gradient-based DNN training from a Dynamic Programming (DP) point of view (DP is an optimisation methodology supported by the division of a complex problem into many problems of lower complexity). To do so, conditions which enable the DNN minimization algorithm to be solved under a DP perspective are studied here. In this line, in this work is proved that any artificial neural network ANN (and thus also DNNs) with monotonic activation is separable. Furthermore, whenever ANNs are considered as a dynamical system in the form of a network (known as coupled cell networks CCNs), we show that the transmission function is a separable function assuming that the activation is non-decreasing.
