Optimizing an expensive multi-objective building performance problem: Benchmarking model-based optimization algorithms against metaheuristics with and without surrogates

While simulation-based optimization can effectively find good solutions, the need to simulate hundreds of candidates and consequent long run-times prevent their application in practice. Accurate and fast surrogate models can replace expensive building performance simulations (BPS). model-based optimization algorithms construct a surrogate during optimization and perform many additional optimization steps quickly. While this strategy has proven effective for expensive single-objective optimization, its performance on multi-objective BPS problems remains understudied. Two questions persist: A) Do model-based multi-objective optimization algorithms outperform metaheuristics and B) How does optimizing on a surrogate model affect the performance of meta- heuristic optimization algorithms? Our benchmark results show that the model-based algorithms RBFMOpt and TPE outperform metaheuristics regarding robustness, maximum hypervolume, and the quality of the found Pareto fronts. RBFMOpt yields good solutions within less than 100 function evaluations. Optimizing on surrogate models heavily depends on the surrogates' ability to estimate precisely but is computationally cheap and allows larger optimization budgets.

A mathematical model representing the phenomena of heat transfer and fluid flow was developed to compute the state variables such as the air mass flow rate, brick and air temperatures along the cooling zone of a tunnel kiln. Using the mathematical model, the optimization of the cooling zone was realized to minimize the pressure drop by finding the optimum suction and blowing air flow rate profiles in addition to the ambient air flow rate entering from the brick exit side. The optimization was realized by considering the cooling zone as a decomposable structured system formed of N interconnected cells. The plant data were used to compare with the model-based optimization results. The measured temperatures from the cooling zone are practically values between the brick and air temperatures. The results showed that the minimum pressure drop was obtained by considering the tunnel kiln cooling zone composed of two regions of suction and two regions of blowing while satisfying the process constraints. The architecture of ARINC-653 partitioned scheduling has been widely applied to avionics systems owing to its robust temporal isolation among applications. However, this partitioning mechanism causes the problem of how to optimize the partition scheduling of a complex system while guaranteeing its schedulability. In this paper, a model-based optimization approach is proposed. We formulate the problem as a parameter sweep application, which searches for the optimal partition scheduling parameters with respect to minimum processor occupancy via an evolutionary algorithm. An ARINC-653 partitioned scheduling system is modeled as a set of timed automata in the model checker UPPAAL. The optimizer tentatively assigns parameter settings to the models and subsequently invokes UPPAAL to verify schedulability as well as evaluate promising solutions. The parameter space is explored with an evolutionary algorithm that combines refined genetic operators and the self-adaptation of evolution strategies. The experimental results show the applicability of our optimization method.

A summary of recent progress in model-based optimization of phased arrays for electromagnetic hyperthermia is reported. The electromagnetic phased array has the potential to overcome many of the difficulties associated with noninvasive hyperthermia, and is more effective if the driving amplitudes and phases of the array are carefully selected. A computationally efficient method for the optimization of the steady-state temperature distribution, a major driver of therapeutic response, has been developed. By employing a dual set of superposition principles, the technique minimizes the number of computationally expensive forward problems that must be solved in the course of an optimization. Additionally, a scheme that employs emerging noninvasive tomographic temperature estimation techniques, such as magnetic resonance thermometry, to perform optimization of a phased array has been developed and demonstrated experimentally. Conclusions about the potential value of each of the developed techniques are reached and directions for further research are indicated.

The performance of fiber reinforced titanium matrix composites (TMC) made by consolidation of spray deposited monotapes is strongly influenced by the processing conditions used. This high temperature consolidation step must simultaneously increase the relative density while minimizing fiber microbending/fracture and the interfacial reaction product layers at the fiber-matrix interface. These three microstructural variables have conflicting dependencies upon the consolidation process variables (temperature. pressure and time), and it has been difficult to experimentally identify process pathways that lead to composites of acceptable quality (where the fiber damage and the reaction layer thickness are kept below some bounds, while matrix porosity is eliminated). Here, models for predicting the microstructure's dependence upon process conditions (i.e. the time varying temperature and pressure) are combined with consolidation equipment dynamics to simulate the microstructure evolution. We then introduce the idea of process failure surfaces and show how a model predictive control algorithm, is able to design 'locally' optimal process cycles that minimize fiber damage, reaction product layer thickness and porosity. As an example, we explore the planning of process schedules that process failure surfaces for several TMC systems. (C) 1998 Elsevier Science S.A. All rights reserved.

A model-based approach for optimization and cascade control of dissolved oxygen partial pressure (pO2) and maximization of biomass in fed-batch cultivations is presented. The procedure is based on the off-line model-based optimization of the optimal feeding rate profiles and the subsequent automatic pO2 control using a proposed cascade control technique. During the model-based optimization of the process, feeding rate profiles are optimized with respect to the imposed technological constraints (initial and maximal cultivation volume, cultivation time, feeding rate range, maximal oxygen transfer rate and pO2 level). The cascade pO2 control is implemented using activation of cascades for agitation, oxygen enrichment, and correction of the preoptimized feeding rate profiles. The proposed approach is investigated in two typical fed-batch processes with Escherichia coli and Saccharomyces cerevisiae. The obtained results show that it was possible to achieve sufficiently high biomass levels with respect to the given technological constraints and to improve controllability of the investigated processes.

An optimized fed-batch cultivation process for the production of the polyoma virus capsid protein VP1 in recombinant Escherichia coli BL21 bacteria is presented. The optimization procedure maximizing the amount of desired protein is based on a mathematical model. The model distinguishes an initial cell growth phase from a protein production phase initiated by inducer injection. A new approach to model the target protein formation rate was elaborated, where product formation is primarily dependent on the specific biomass growth rate. Lower growth rates led to higher specific protein concentrations. The model was identified from a series of fed-batch experiments designed for parameter identification purposes and possesses good prediction quality. Then the model was used to determine optimal open-loop control profiles by manipulating the substrate feed rates in both phases as well as the induction time. Feed-rate optimization has been solved using Pontryagin's maximum principle. The solution was validated experimentally. A significant improvement of the process performance index was achieved.

The necessity to move towards a more sustainable mobility calls also for more efficient high-performance vehicles, which still fulfill dynamic requirements, namely, fast accelerations and limited weight. This study addresses the problem of series-hybrid powertrain mass minimization;the paper proposes sizing methodologies suitable to determine the combination of any number of primary storage systems (such as batteries and supercapacitors) that is optimal in terms of mass. The application of such methodologies indicates that it is possible to realize storage systems of about 33 kg and suitable to satisfy the power and energy requirements characterizing a representative mission profile, while achieving fuel savings in excess of 20% with respect to the ICE-only architecture.

model-based optimization (MBO) is a method to optimize expensive black-box functions that uses a surrogate to guide the search. We propose two practical approaches that allow MBO to optimize black-box functions where the relation between input and output changes over time, which are known as dynamic optimization problems (DOPs). The window approach trains the surrogate only on the most recent observations, and the time-as-covariate approach includes the time as an additional input variable in the surrogate, giving it the ability to learn the effect of the time on the outcomes. We focus on problems where the change happens systematically and label this systematic change concept drift. To benchmark our methods we define a set of benchmark functions built from established synthetic static functions that are extended with controlled drifts. We evaluate how the proposed approaches handle scenarios of no drift, sudden drift and incremental drift. The results show that both new methods improve the performance if a drift is present. For higher-dimensional multimodal problems the window approach works best and on lower-dimensional problems, where it is easier for the surrogate to capture the influence of the time, the time-as-covariate approach works better.

Amplitude Modulation Spectrum (AMS) features can be implemented as a cascade of two filter banks whereas the filter bandwidths can be optimized for a particular application. In this work we train AMS-based features using a combination of a model-based optimization (MBO) approach and feature selection for full-band DRR and full-band T-60 estimation. MBO replaces the computational complex data-based cost function by approximating a less complex surrogate model and thus reduces the time needed for training. We evaluate our approach on the publicly available ACE challenge corpus and achieve with only five features the best RMSE in the DRR estimation task using the single microphone configuration and upper mid-range performance for T-60 estimation. The computational complexity of our algorithm is much lower than all other submitted algorithms.
